In traditional machine learning, we often treat data points as independent and identically distributed (i.i.d.). For example, when classifying images of cats and dogs, the model looks at one image at a time, and the order in which those images are presented does not change the identity of the cat in the picture. However, much of the most important data in the real world does not follow this rule. In text, audio, and time series, the meaning of a single data point is inextricably linked to the points that came before it. This is the essence of sequential data.

The Core Characteristics of Sequential Data

To master deep learning for sequences, one must move beyond the idea of static inputs and embrace three fundamental characteristics: temporal dependency, variable length, and contextual meaning.

1. Temporal Dependency

Temporal dependency refers to the fact that the "order" of data points matters. In a sequence, the value at time step tt is often highly correlated with the value at time step t−1t-1.

Consider a weather sensor recording temperature. If the temperature at 12:00 PM is 30∘C30^\circ\text{C}, it is highly likely that the temperature at 12:01 PM will be close to 30∘C30^\circ\text{C}, rather than suddenly jumping to −10∘C-10^\circ\text{C}. This relationship allows us to use past information to predict future states.

2. Variable Length

Unlike a standard image dataset where every input might be a 224×224224 \times 224 pixel matrix, sequential data is rarely uniform in size. A sentence in a book might be five words long, while the next sentence is twenty words long. An audio clip might last three seconds, while another lasts ten.
